Scale distributed data shuffling for large datasets
Solve slow data shuffling by iteratively reducing shuffle size across passes.
Implement a multi-pass shuffling approach. In each pass, N jobs read 1/N of the dataset, shuffle it, and write out K files, each containing 1/NK of the data. This reduces the size of subsequent shuffles. Repeat passes until the shuffle fits in memory on a single machine.
Shuffling large datasets (100TB+) takes hours or days, becoming a bottleneck.
Initial shuffling methods do not scale beyond single machine memory or require reading the entire dataset multiple times.
When shuffling large datasets for AI model training becomes a bottleneck, use a multi-pass approach. Each pass reduces the data size needing shuffling, allowing you to scale beyond single-machine memory limits and solve the problem efficiently.
This method breaks down a large, unmanageable shuffle into a series of smaller, manageable shuffles. By iteratively reducing the data size, it eventually makes the shuffle fit within available memory, solving the scaling problem.
This is for large-scale data shuffling where performance is critical, not for small datasets.
